Is there a way to make the audio player never show up?

I think the closest you can get is to make sure it cannot be activated by a touch or pedal press which you can check in the global settings. Then the only way it can be activated is using the icon in the quick action pop-up or the icon in overlay mode.
Dell Latitude 13.5" 2-in-1 Ubuntu/Win 11
Samsung Note Pro SM-P900 12.2 Android 5.0.2

Thanks. I must be missing it. I don't see where it can be handled in the settings.

If you go under Settings->Touch & Pedal Settings->Touch Actions, you wiull see that "Show or Hide Audio Player" is assigned to the bottom center by default. Just switch that to None. As long as you don't associate audio files with any of your songs, the player should never be shown.
